WWW.MICROSOFT.COMDebug-gym: an environment for AI coding tools to learn how to debug code like programmersThe ongoing proliferation of AI coding tools is not only boosting developers’ efficiency, it also signals a future where AI will generate a growing share of all new code. GitHub CEO Thomas Dohmke (opens in new tab) predicted as much in 2023, when he said that “sooner than later, 80% of the code is going to be written by Copilot.” Both large and small software companies are already heavily using AI to generate code. Y Combinator’s Garry Tan (opens in new tab) noted that 95% of code for a quarter of Y Combinator’s latest batch of startups was written by large language models. In fact, most developers spend the majority of their time debugging code, not writing it. As maintainers of popular open-source repositories, this resonates with us. But what if an AI tool could propose fixes for hundreds of open issues, and all we had to do was approve them before merging? This was what motivated us to maximize the potential time savings from AI coding tools by teaching them to debug code. By debugging we mean the interactive, iterative process to fix code. Developers typically hypothesize why their code crashed, then gather evidence by stepping through the program and examining variable values. They often use debugging tools like pdb (Python debugger) to assist in gathering information. This process is repeated until the code is fixed. Today’s AI coding tools boost productivity and excel at suggesting solutions for bugs based on available code and error messages. However, unlike human developers, these tools don’t seek additional information when solutions fail, leaving some bugs unaddressed, as you can see in this simple demo of how a mislabeled column stumps today’s coding tools (opens in new tab). This may leave users feeling like AI coding tools don’t understand the full context of the issues they are trying to solve. Introducing debug-gym A natural research question emerges: to what degree can LLMs use interactive debugging tools such as pdb? To explore this question, we released debug-gym (opens in new tab) – an environment that allows code-repairing agents to access tools for active information-seeking behavior. Debug-gym expands an agent’s action and observation space with feedback from tool usage, enabling setting breakpoints, navigating code, printing variable values, and creating test functions. Agents can interact with tools to investigate code or rewrite it, if confident. We believe interactive debugging with proper tools can empower coding agents to tackle real-world software engineering tasks and is central to LLM-based agent research. The fixes proposed by a coding agent with debugging capabilities, and then approved by a human programmer, will be grounded in the context of the relevant codebase, program execution and documentation, rather than relying solely on guesses based on previously seen training data. In most existing approaches (shown in black), an agent rewrites its code conditioned on error messages obtained from executing the code. debug-gym equips the agent with additional tools such as pdb (shown in red), so it can interactively seek necessary information from the semantic space hidden behind the code and therefore have better code-repairing performance. Debug-gym is designed and developed to: Handle repository-level information: the full repository is available to agents in debug-gym, allowing them to navigate and edit files. Be robust and safe: to safeguard both the system and the development process, debug-gym runs code within sandbox Docker containers. This isolates the runtime environment, preventing harmful actions while still allowing thorough testing and debugging. Be easily extensible: debug-gym was conceived with extensibility in mind and provides practitioners with the possibility of easily adding new tools. Be text-based: debug-gym represents observation information in structured text (e.g., JSON format) and defines a simple syntax for text actions, making the environment fully compatible with modern LLM-based agents. With debug-gym, researchers and developers can specify a folder path to work with any custom repository to evaluate their debugging agent’s performance. Additionally, debug-gym includes three coding benchmarks to measure LLM-based agents’ performance in interactive debugging: Aider for simple function-level code generation, Mini-nightmare for short, hand-crafted buggy code examples, and SWE-bench for real-world coding problems requiring a comprehensive understanding of a large codebase and a solution in the format of a GitHub pull request. Early experimentation: promising signal For our initial attempt to validate that LLMs perform better on coding tests when they have access to debugging tools, we built a simple prompt-based agent and provided it with access to the following debug tools: eval, view, pdb, rewrite, and listdir. We used nine different LLMs as the backbone for our agent. Detailed results can be found in the technical report (opens in new tab). (opens in new tab) Even with debugging tools, our simple prompt-based agent rarely solves more than half of the SWE-bench (opens in new tab)Lite issues. We believe this is due to the scarcity of data representing sequential decision-making behavior (e.g., debugging traces) in the current LLM training corpus. However, the significant performance improvement (as shown in the most promising results in the graph below) validates that this is a promising research direction. Listen now Opens in a new tab Future work We believe that training or fine-tuning LLMs can enhance their interactive debugging abilities. This requires specialized data, such as trajectory data that records agents interacting with a debugger to gather information before suggesting a fix. Unlike conventional reasoning problems, interactive debugging involves generating actions at each step that trigger feedback from the environment. This feedback helps the agent make new decisions, requiring dense data like the problem description and the sequence of actions leading to the solution. Our plan is to fine-tune an info-seeking model specialized in gathering the necessary information to resolve bugs. The goal is to use this model to actively build relevant context for a code generation model. If the code generation model is large, there is an opportunity to build a smaller info-seeking model that can provide relevant information to the larger one, e.g., a generalization of retrieval augmented generation (RAG), thus saving AI inference costs. The data collected during the reinforcement learning loop to train the info-seeking model can also be used to fine-tune larger models for interactive debugging. We are open-sourcing debug-gym to facilitate this line of research. We encourage the community to help us advance this research towards building interactive debugging agents and, more generally, agents that can seek information by interacting with the world on demand. Get the Popular Science daily newsletter💡 After surviving a likely gunshot wound in July, a bald eagle in Missouri is showing an important sign of recovery–keratin growth on his severely injured beak. According to World Bird Sanctuary, a nonprofit that treats and houses injured raptors, it’s taken nearly nine months and seven surgeries to get the bird’s beak growing again. “While this growth is still no guarantee that the keratin will regrow over his entire beak, it gives us hope that we may start to see the growth area spreading as we move forward,” the organization wrote in a recent Facebook post. Bald Eagle 390’s story On July 11, 2024 a male bald eagle (later designated as Bald Eagle 24-390 or just 390 for short) was spotted on the side of the road near Vienna, Missouri with an obvious facial injury. “Based on the pattern of damage to the beak and trace amounts of metal found in the wound, we believe the injury to be caused by a gunshot wound,” Kira Klebe, World Bird Sanctuary’s Rehabilitation Director, tells Popular Science. “390 also had a large wound over his left humerus that was consistent with gunshot injury.” The injured bird was taken into the rehabilitation center, where his wounds were cleaned out and evaluated. Veterinarian Dr. Allison Daugherty and her team performed an initial surgery and placed eight metal cross pins, two on each side of the fracture on the bird’s beak. Eagle beaks and talons are made of keratin, a strong type of protein that helps form skin, hair, and other outer layers of skin on a variety of animals. The team’s biggest concerns for 390’s recovery since July has been that the growth bed would be too damaged for the keratin to regrow and that the bone that supports the entire structure of the upper beak may have too much missing and grow back together. A significant chunk of that bone was missing due to the eagle’s initial injury, limiting the amount of tissue and blood that carries nutrients to the outer half of that bone. “Gunshot wounds are also inherently dirty and carry a higher risk of infection and non-union fracture healing than fractures from other sources such as vehicle collisions,” says Klebe. Since first arriving at the sanctuary, 390 has had seven additional surgeries and “countless cleanings” to keep the beak from getting infected. The team was able to remove the external support in October and added a dental acrylic covering over the gap in the bone until late March. [ Related: Hunters’ bullets are poisoning bald eagles. ] How to heal an eagle The keratin that makes up a bird’s beak and talons is similar to human nails. When it is healthy, keratin is constantly growing. Wild raptors like eagles, hawks, and falcons, need this continual keratin growth to keep their beaks and talons sharp for hunting. “For birds under human care, the beak and talons can actually become overgrown, as they are not being used as frequently and therefore wear down more slowly than that of wild birds,” explains Klebe. “Birds under professional care can also experience faster beak and talon growth than their wild counterparts as birds under professional care are typically receiving ideal nutritional intake.” A speal eagle beak splint made using popsicle sticks. CREDIT: World Bird Sanctuary. To try and promote faster keratin growth in a bird like 390, the primary course of action is good nutrition and a low-stress environment. Eating a balanced diet with the right amount of nutrients gives their bodies the energy that they need to put the nutrients right back into beak growth, instead of just essential metabolic needs. 390 receives a vitamin supplement customized for raptors and extra calcium supplements with his daily feedings. “Stress can also limit beak growth as it puts the animal in survival mode and added energy is going to stress management,” says Klebe. “While a rehabilitation setting is always going to have some inherent stressors, we are making sure we do everything possible to promote a healthy environment for 390’s recovery.” On April 5, the organization announced that keratin was starting to grow on the right side of 390’s beak. The keratin is growing over the area of the beak that was first to heal and is “coming in a bit rough.” The team will likely need to smooth it out using a Dremel as it grows to try and keep it forming into its natural state. What’s next for 390? To keep 390’s day-to-day life as calm as possible, the eagle has been in one of the largest rehabilitation aviaries since February. While he is also able to interact with other bald eagles in this area, human contact is a bit more limited. “These aviaries are behind the scenes and amongst our farthest removed from human activity so that 390 is minimally disturbed,” says Klebe. “These are large enough for him to fly around in and maintain good muscle strength.” Now that the bone is finished healing and the keratin is growing, the team will mostly have to be patient. While they will be closely monitoring the wearing of the older keratin on his upper beak, they will try to be as hands off as possible to minimize stress levels. “Even if the keratin starts to regrow over the entire beak, 390 will likely require another full year of care before the beak has regrown to the point that he can be released back to the wild,” says Klebe. 390 standing on a mew. What to do if you find an injured bird According to Audubon New York, if you find an injured bird, carefully place it in a cardboard box with a lid or towel covering it. Place the box in a cool, safe place to help keep the bird from going into shock. As soon as possible, call your local animal control office for further information. Eoin Ryan By Meghan Rosen 2 hours ago In late 2022, pharmacist Joseph Lambson got an unusual call from a poison control specialist. He said, “Hey Joe, I’m getting these weird calls about semaglutide.” According to the specialist’s calculations, people were giving themselves 10 times the correct dose. But that didn’t make sense. The drug is the key ingredient in the blockbuster diabetes and weight-loss medications Ozempic and Wegovy. Both come in prefilled injector pens, which typically take the guesswork out of dosing. Lambson, a board-certified toxicologist, knew right away what was going on. “This drug is probably being compounded,” he remembers thinking. He was right. After investigating, Lambson’s team at the Utah Poison Control Center in Salt Lake City reported that people were overdosing on compounded semaglutide. That means “a lot of nausea, a lot of vomiting, a lot of diarrhea,” he says. Ozempic and Wegovy, made by Novo Nordisk, had both been on the U.S. Food and Drug Administration’s drug shortage list since 2022. Across the boundless wilds of the internet, online sellers sprang up to meet demand. Some sold compounded medications. When pharmaceutical companies can’t keep up with demand for their FDA-approved drugs, compounding pharmacies can step in to fill the gap. These pharmacies measure and mix a drug’s active ingredient, creating a product that’s essentially a copy of the brand-name drug. Outside of shortages, compounding pharmacies routinely provide medicines that aren’t otherwise available or need to be tailored to a particular patient. Melanie T. shows a syringe and a vial of compounded tirzepatide, which she got with a prescription from a telehealth company.Melanie T. But even with legal, compounded forms of semaglutide, which require a prescription and usually come premixed in a vial with a syringe, patients can run into trouble, as Lambson found. People weren’t always sure how to take the drugs, so “they just went for it,” he says. Last year in Clinical Toxicology, emergency medicine doctors reported similar issues in a few cases. One man injected 20 times the correct dose of semaglutide because he misunderstood instructions. Semaglutide belongs to a class of medications known as GLP-1 receptor agonists. Even when used correctly under doctor supervision, they come with potential side effects. And when patients have to pull up the correct dose with a syringe, the risks go up. Soon, the situation could get even dicier. In February, the FDA removed semaglutide from the drug shortage list. By May, pharmacies will no longer be able to dispense compounded versions, though that depends on ongoing litigation. It’s a similar story with another GLP-1 drug, tirzepatide, the main ingredient in Mounjaro and Zepbound, Eli Lilly’s diabetes and weight-loss drugs. The FDA erased tirzepatide from the drug shortage list in October. But just because a drug is off the list doesn’t mean supply is guaranteed. And even with new discounts offered by pharmaceutical companies, the drugs’ prices keep them out of reach for many patients — especially since insurance won’t always cover them.
